Revolutionizing P300 BCI Performance: Can We Hack the Inter-Subject Variability Barrier?

Accurately decoding P300 event-related potentials from raw EEG is difficult due to low signal-to-noise ratios and variations between individual brains, making traditional single-trial classification too unreliable for real-time applications.

Leonid Sidorov, Anna Makarova, Archil Maysuradze, and Mikhail Lebedev systematically mapped out and compared seven different data aggregation strategies to push Information Transfer Rates (ITR) to their theoretical limits.

Using a 10-subject P300 speller dataset, we put two deep learning convolutional neural networks, EEGNet and BaseCNN, head-to-head against a classical Support Vector Machine.

We evaluated distinct ways to slice, dice, and pool EEG data. These included subject-specific and pooled general models for single trials, standard epoch averaging with 5 and 10 stimulus repetitions, multi-channel models treating separate subjects as distinct input channels, cross-subject averaging, mixed averaging from an uncontrolled pool of trials, a combined approach with three trials per subject pooled across all participants, and time-shifted channels constructed from extended single-trial epochs.

Our data showed that single-trial classification remains impractical. Individual models yielded highly variable results, with SVM leading the baseline pack at a mean ITR of 0.64 bits/trial, while EEGNet averaged 0.35 bits/trial and BaseCNN trailed at 0.15 bits/trial. Pooling data into a generalized universal model did not move the needle much further, peaking at 0.63 bits/trial.

However, major breakthroughs occurred when changing the aggregation architecture. When we treated all 10 subjects as individual input channels, the networks automatically learned optimal spatial weights, causing the multi-channel EEGNet to jump to an ITR of 0.86 bits/decision unit with an accuracy of 98.3% without any hard-coded averaging.

The absolute winner was the combined cross-subject approach using multi-channel EEGNet across 30 total channels. This strategy achieved a staggering 0.95 bits/aggregated decision in standard, unrestricted no-aperture recordings, and a phenomenal 0.97 bits/aggregated decision on Aperture data where visual fields were restricted to isolate stimuli. This phenomenal performance brings the system incredibly close to the absolute theoretical binary-classification limit of 1.0 bit.

The neuroscience takeaway is clear. Controlled cross-subject averaging consistently outperforms random trial mixing, and multi-channel deep learning architectures outperform simple mathematical averaging if the underlying inter-subject structure is preserved during training. Furthermore, when peering inside the models, the neural networks naturally assigned the highest weights to the subjects who possessed the most stable, distinct individual P300 topographies, proving the networks learn genuine physiological features rather than just memorizing noise.

These findings offer a clear, practical roadmap for designing next-generation, multi-subject Brain-Computer Interfaces.
